Özet

Bu çalışmada, Türkiye elektrik piyasasında gün öncesi piyasasında oluşan piyasa takas fiyatlarının kısa vadeli tahminine yönelik kapsamlı ve hibrit bir model yaklaşımı geliştirilmiştir. Elektrik piyasaları, arz ve talep dengesinin saatlik bazda yeniden oluştuğu, çok sayıda ekonomik, teknik ve çevresel faktörden etkilenen karmaşık yapılardır. Özellikle yenilenebilir enerji kaynaklarının üretim portföyündeki payının artmasıyla birlikte fiyat oluşum mekanizmaları daha belirsiz ve değişken bir yapı kazanmıştır. Talep dalgalanmaları, yenilenebilir üretimdeki öngörü hataları, hava koşulları, ithalat–ihracat dengesi ve santral bazlı operasyonel kısıtlar fiyat dinamiklerini doğrudan etkilemekte; bu durum piyasa takas fiyatı serilerinde yüksek oynaklık ve ani sıçramalara neden olmaktadır. Bu bağlamda, güvenilir kısa vadeli fiyat tahmini, hem piyasa katılımcılarının stratejik karar süreçleri hem de sistem işletmecilerinin operasyonel planlamaları açısından kritik bir gereklilik haline gelmiştir. Çalışma kapsamında, Türkiye elektrik piyasasına özgü temel fiyat belirleyicileri dikkate alınarak çok boyutlu bir veri seti oluşturulmuştur. Bu veri seti, başta EPİAŞ Şeffaflık Platformu olmak üzere farklı açık veri kaynaklarından elde edilen üretim bileşenleri, tüketim verileri, ithalat–ihracat akışları, santral arıza ve bakım bilgileri ile meteorolojik değişkenleri içermektedir. Sıcaklık, rüzgar hızı ve bulutluluk gibi hava durumu değişkenleri, özellikle yenilenebilir üretim üzerindeki etkileri nedeniyle modele dahil edilmiştir. Ayrıca, piyasa davranışlarını daha doğru temsil edebilmek amacıyla takvim etkileri, mevsimsellik ve resmi tatil değişkenleri de veri setine entegre edilmiştir. Özellik mühendisliği sürecinde, zaman serisi modelleme yaklaşımını desteklemek amacıyla gecikmeli fiyat değişkenleri oluşturulmuş ve sistemin arz-talep dengesini temsil eden türetilmiş değişkenler geliştirilmiştir. Bu kapsamda, artık talep gibi değişkenler aracılığıyla sistemdeki net yük daha analitik bir biçimde modellenmiştir. Bununla birlikte, model performansını olumsuz etkileyebilecek çoklu doğrusal bağlantı problemi ayrıntılı olarak incelenmiş ve çoklu doğrusal bağlantı faktörü (VIF) analizi kullanılarak yüksek korelasyon içeren değişkenler belirlenmiştir. Elde edilen bulgular doğrultusunda, model stabilitesini artırmak ve aşırı öğrenme riskini azaltmak amacıyla uygun değişken seçimi ve düzenlemeleri yapılmıştır. Modelleme aşamasında, istatistiksel yöntemler, artırma tabanlı makine öğrenmesi algoritmaları ve derin öğrenme modelleri birlikte değerlendirilmiştir. Bu sayede hem doğrusal hem de doğrusal olmayan ilişkilerin yakalanması hedeflenmiştir. Farklı özellik setleri altında çok sayıda model eğitilmiş ve her bir modelin performansı çeşitli hata metrikleri ile analiz edilmiştir. Model performansının değerlendirilmesinde ortalama mutlak hata, kök ortalama kare hata, ortalama mutlak yüzde hata ve Huber kaybı gibi metrikler birlikte kullanılmıştır. Tek bir hata metriğinin model performansını tam olarak yansıtamaması nedeniyle, çalışmada bu metriklerin birleşiminden oluşan hibrit bir değerlendirme ölçütü geliştirilmiştir. Bu ölçüt, büyük hatalara daha duyarlı olan kök ortalama kare hatayı, genel hata performansını yansıtan ortalama mutlak hata ile dengelemekte ve uç değerlerin etkisini sınırlamak amacıyla Huber kaybını da içermektedir. Bu yaklaşım sayesinde hem ani fiyat sıçramalarının yakalanması hem de genel tahmin doğruluğunun korunması sağlanmıştır. Geliştirilen hibrit skor kullanılarak her saat için en iyi performans gösteren model seçilmiş ve saatlik bazda dinamik bir model seçim mekanizması oluşturulmuştur. Elde edilen bulgular, farklı model türlerinin piyasa dinamiklerini yakalama kapasitesinin önemli ölçüde değiştiğini göstermektedir. Geleneksel istatistiksel modellerin doğrusal olmayan ve rejim değişimlerine sahip yapıları modellemede yetersiz kaldığı gözlemlenmiştir. Artırma tabanlı algoritmaların ani fiyat hareketlerini ve karmaşık ilişkileri daha başarılı şekilde yakalayabildiği, ancak bazı durumlarda ortalama fiyat seviyesini korumakta zorlandığı belirlenmiştir. Derin öğrenme modellerinin daha düzgün ve pürüzsüz tahminler ürettiği, ancak keskin fiyat değişimlerini yeterince yansıtamadığı tespit edilmiştir. Önerilen hibrit yaklaşım ise bu farklı model ailelerinin güçlü yönlerini bir araya getirerek daha dengeli ve tutarlı bir tahmin performansı sunmuştur. Sonuç olarak, geliştirilen model çerçevesi Türkiye elektrik piyasasında kısa vadeli fiyat tahmin doğruluğunu artırmakta ve piyasa katılımcılarına karar destek açısından önemli katkılar sağlamaktadır. Modelin uygulanabilir yapısı, teklif stratejilerinin belirlenmesi, portföy yönetimi ve risk analiz süreçlerinin iyileştirilmesine olanak tanımaktadır. Gelecek çalışmalar kapsamında, geliştirilen fiyat tahminlerinin doğrudan optimizasyon modellerine entegre edilerek maksimum kâr odaklı karar mekanizmalarında kullanılması önemli bir araştırma alanı olarak öne çıkmaktadır. Bunun yanı sıra, dengeleme piyasasına yönelik yön tahmin modellerinin geliştirilmesi, kısa vadeli operasyonel kararların doğruluğunu artırabilir. Ayrıca, olasılıksal tahmin yaklaşımlarının entegrasyonu, rejim değişim modellerinin kullanımı ve daha yüksek frekanslı veri setlerinin dahil edilmesi ile model performansının daha da geliştirilmesi mümkündür. Bu doğrultuda, önerilen yaklaşımın gelecekte uçtan uca bir karar destek sistemi haline dönüştürülmesi hedeflenmektedir.

Electricity markets are inherently complex systems in which prices are determined through the continuous interaction of supply and demand under a wide range of operational, economic, and environmental constraints. In liberalized electricity markets such as Turkey, the day-ahead market constitutes the primary platform where hourly market clearing prices are formed based on bids submitted by market participants. These prices reflect the marginal cost of the last generation unit required to meet demand and are shaped by a combination of demand variability, generation mix, fuel prices, transmission constraints, weather conditions, and regulatory mechanisms. The merit-order structure, which prioritizes generation units based on marginal costs, plays a fundamental role in this process, particularly in systems with high shares of renewable energy. In recent years, the increasing penetration of renewable energy sources, especially wind and solar, has significantly transformed the dynamics of electricity price formation. While these sources contribute to decarbonization goals and reduce reliance on fossil fuels, their intermittent and non-dispatchable nature introduces substantial uncertainty into the system. As a result, electricity price series exhibit pronounced volatility, nonlinear behavior, and abrupt fluctuations, often characterized by sharp spikes and regime shifts. These characteristics pose significant challenges for traditional modelling approaches and necessitate the development of more advanced forecasting frameworks capable of capturing complex relationships within the data. Accurate short-term electricity price forecasting has become increasingly critical for a wide range of stakeholders, including generation companies, energy traders, and system operators. Reliable forecasts enable more effective bidding strategies, improved portfolio optimization, and enhanced risk management. Moreover, accurate price signals support system-level decisions such as unit commitment, dispatch planning, and reserve allocation. Despite the extensive body of literature on electricity price forecasting, no single modelling approach has proven universally superior due to the inherent complexity and non-stationarity of electricity price series. In this context, this study proposes a comprehensive hybrid modelling framework for short-term forecasting of market clearing prices in the Turkish day-ahead electricity market. The proposed approach integrates statistical methods, boosting-based machine learning algorithms, and deep learning models within a unified structure, aiming to exploit the complementary strengths of each modelling paradigm. By combining linear and nonlinear modelling capabilities, the framework seeks to improve both accuracy and robustness, particularly under highly volatile market conditions. A key component of the study is the construction of a comprehensive dataset that captures the fundamental drivers of electricity price formation. The primary target variable consists of hourly market clearing prices obtained from the EPİAŞ Transparency Platform. In addition to price data, multiple data sources were integrated to enrich the dataset, including electricity demand, generation by source type, import–export flows, and power plant outage and maintenance information. These variables provide critical insights into supply-demand balance and system constraints. Meteorological variables, such as temperature, wind speed, and cloud cover, were incorporated due to their direct influence on renewable energy generation and electricity consumption patterns. For instance, temperature variations affect both heating and cooling demand, while wind and solar conditions directly impact renewable generation output. The inclusion of these variables allows the model to better capture exogenous drivers of price fluctuations. Additionally, temporal variables including hourly indicators, day-of-week effects, monthly seasonality, and public holidays were integrated to account for recurring patterns and structural variations in electricity consumption and generation behavior. Feature engineering plays a central role in enhancing the predictive performance of the models. Lagged price variables, particularly 24-hour and 168-hour lags, were introduced to capture autocorrelation structures and recurring temporal patterns in electricity prices. Furthermore, derived variables representing system balance conditions were constructed to provide a more analytical representation of the relationship between demand and supply. These variables serve as proxies for system stress and scarcity conditions, which are key determinants of price spikes. To ensure the robustness and interpretability of the model, multicollinearity among explanatory variables was carefully analyzed using Variance Inflation Factor analysis. The results indicated strong dependencies among certain variables, particularly those derived from similar components such as demand and residual demand. Based on these findings, redundant features were removed or redefined to reduce overfitting risk and improve model stability. This step is crucial for ensuring that the model captures meaningful relationships rather than spurious correlations. The modelling framework incorporates multiple model families to capture different aspects of the data. Statistical models provide a structured approach to modelling temporal dependencies and are particularly useful for capturing linear relationships. Boosting-based machine learning algorithms, on the other hand, are highly effective in modelling nonlinear interactions and capturing complex patterns, including extreme price movements. Deep learning models introduce an additional layer of flexibility by learning hierarchical representations and capturing intricate dependencies within the data. Multiple feature sets were constructed and evaluated systematically across different models to assess the impact of input variables on forecasting performance. Each model was trained and validated using time-series-aware evaluation strategies to ensure that temporal dependencies are preserved and data leakage is avoided. The use of rolling or expanding window approaches allows the model to simulate real-world forecasting conditions more accurately. Model performance was assessed using a combination of error metrics, including mean absolute error, root mean squared error, mean absolute percentage error, and Huber loss. Each metric captures a distinct dimension of forecasting accuracy. Root mean squared error emphasizes large deviations, making it sensitive to price spikes, while mean absolute error provides a balanced measure of overall performance. Huber loss introduces robustness by reducing the influence of extreme outliers, which are common in electricity price series. Given the limitations of individual metrics, a hybrid performance measure was developed by combining these metrics into a single composite score. This hybrid score balances sensitivity to large errors with robustness and overall accuracy, providing a more comprehensive evaluation framework. Based on this metric, the best-performing model was selected independently for each hour, resulting in a dynamic model selection mechanism. This approach allows the framework to adapt to varying market conditions throughout the day by leveraging the strengths of different models. The empirical results demonstrate that no single model consistently outperforms others across all conditions. Traditional statistical models were found to be limited in capturing nonlinear and regime-dependent behavior, often leading to suboptimal performance during periods of high volatility. Boosting-based algorithms exhibited strong performance in capturing price spikes and complex interactions but occasionally struggled with maintaining stable average predictions. Deep learning models produced smoother forecasts, which reduced noise but sometimes underestimated sharp fluctuations. The hybrid framework successfully integrates these different modelling approaches and achieves improved forecasting performance by dynamically selecting the most suitable model for each hour. This results in a more balanced representation of both average price behavior and extreme events. The ability to capture price spikes while maintaining overall accuracy is particularly valuable for practical applications in energy trading and system operations. From a practical perspective, the proposed framework provides a powerful decision support tool for market participants. Accurate price forecasts can enhance bidding strategies, improve portfolio management, and support risk mitigation efforts. The flexibility and scalability of the framework make it suitable for real-time applications and integration into operational systems. Beyond forecasting, the results highlight the potential for integrating price forecasts into optimization-based decision-making frameworks. Future research directions include the integration of forecasting models with optimization models for maximum profit-oriented decision-making. Predicted price trajectories can be used to determine optimal bidding strategies, generation scheduling, and portfolio allocation decisions. Additionally, the development of direction forecasting models for balancing markets represents a promising area for further research, enabling the prediction of upward and downward regulation needs and supporting short-term operational decisions. The incorporation of probabilistic forecasting methods offers another important extension, allowing decision-makers to explicitly account for uncertainty in price predictions. Furthermore, integrating regime-switching models, intraday market dynamics, and higher-frequency data may further enhance the model's ability to capture complex market behavior. Ultimately, the proposed framework provides a strong foundation for the development of integrated decision support systems that combine forecasting and optimization within a unified structure. In conclusion, this study contributes to the literature by presenting a robust and flexible hybrid modelling framework for short-term electricity price forecasting in the Turkish day-ahead market. By combining multiple modelling approaches and leveraging comprehensive feature engineering, the proposed method improves forecasting accuracy and robustness under highly volatile conditions. The framework not only addresses key challenges in electricity price forecasting but also provides practical value for market participants by supporting data-driven decision-making processes.
