Özet

Uzaktan algılama görüntülerinden gemi tespiti; liman yönetimi, arama-kurtarma operasyonları ve kıyı güvenliği konularına dair sağladığı kritik bilgiler nedeniyle denizcilik çalışmalarında önemli bir konumdadır. Özellikle deniz taşımacılığı aktivitelerinin izlenmesinde optik uydu görüntülerinin kullanımı, bu görüntülerin kolay erişilebilir, düşük maliyetli ve ücretli uydu görüntülerine alternatif olmasından dolayı araştırmacılar tarafından ilgi görmüştür. Ancak, düşük bir ücret karşılığı temin edilen ya da açık veri kapsamında yer alan optik uydu görüntülerinin büyük bir kısmı düşük-orta mekansal çözünürlüklüdür. Bir uydu görüntüsünde nesne özellik ve dokularına dair detaylar, görüntünün mekansal çözünürlüğüne bağlıdır. Mekansal çözünürlüğün düşük olması sebebiyle daha az özellik detayına sahip nesneler, nesne tespit modelleri tarafından gözden kaçmaktadır ve bu durum model performansının düşmesine sebep olmaktadır. Süper-çözünürlük, düşük kalitede görüntülerden yüksek kaliteli görüntülerin üretilerek nesne detaylarının artırıldığı iyileştirme süreçlerini ifade etmektedir ve bu süreçlerin nesne tespit performansı üzerindeki etkisi literatürde bir çok nesne tespit çalışmasına konu olmuştur. Optik uydu görüntülerinin iyileştirilmesi ile nesne tespit model doğruluğunu artırmada, derin öğrenme destekli süper-çözünürlük teknikleri büyük bir önem arz etmektedir. Bu tez çalışmasında, süper-çözünürlüğün Sentinel-2A görüntülerinden gemilerin tespit edilebilirliğine etkisi araştırılmıştır. Güncel üretken çekişmeli ağ türlerinden Real-ESRGAN, gemilerin tespit edilmesinin öncesinde bir ön işlem adımı olarak Sentinel-2A görüntülerinin iyileştirilmesinde kullanılmıştır. Görüntü iyileştirme için Dataset-1, gemi tespiti için ise Dataset-2 adında iki adet veriseti üretilmiştir. PlanetScope görüntülerinde (Dataset-1) eğitilmiş Real-ESRGAN modeli ile Sentinel-2A görüntüleri (Dataset-2) dört kat iyileştirilmiştir. Süper-çözünürlüğün YOLOv10 model performansına etkisini gözlemlemek için, orijinal ve iyileştirilmiş Sentinel-2A görüntülerinden gemi tespitleri görsel ve istatistiksel olarak karşılaştırılmıştır. Kesinlik, duyarlılık, mAP50 ve mAP50-95 performans metrikleri ile performans değerlendirmesi sonucunda mAP50 ve mAP50-95 değerlerinde %2.6'lık artış görülmüştür. Gemilerden kaynaklı emisyonların tahmin edilmesinde çoğunlukla atmosfer verileri tercih edilmektedir. Optik uydu görüntülerinin atmosferik veriler ile karşılaştırıldığında emisyonların tahmininde sınırlı kullanım alanı olması sebebiyle, bu tez çalışmasında iyileştirilmiş Sentinel-2A görüntülerinden çıkarımı yapılan gemi örnekleri Anvers limanında gemilerden kaynaklı emisyon tahmininde kullanılmıştır. Sonuç olarak, ton cinsinden aylık olarak hesaplanan karbondioksit (CO2), nitröz oksit (N2O) ve metan (CH4) emisyon miktarları mart 2022'de sırasıyla, 26 448, 2.43 and 0.69 ton bulunmuştur.

Ship detection in remote sensing imagery has become prominent in maritime studies due to the insights it provides in port management, search and rescue operations, and coastal safety. Particularly, use of optical satellite images for maritime transportation has gained tremendous attention because they are low-cost, accessible and alternative to commercial satellite data. However, the majority of the optical satellite imagery with little to no cost is at medium-to-low spatial resolution. The amount of detail and texture in these images depend largely on spatial resolution. Object detection models encounter difficulties about identifying an object with fewer feature details, resulting in low detection performance. Super-resolution comprises a set of enhancement processes for recovering object features in an image and is known for improving the performance of object detection models by enhancing the visual quality of images. Although the demonstration of this impact analysis was initiated with natural images, application of super-resolution techniques has been extended to satellite data as well. In addition to natural images, a large body of research has been conducted regarding the enhancement of optical satellite images for more robust object detection. As a cost-effective option to high resolution commercial satellite data, super-resolution techniques offer an alternative cost-friendly way to obtain high-quality optical satellite data. Upgrading optical satellite images to higher spatial resolution is necessary to improve the accuracy of object detection models implemented on these images. Sentinel-2A imagery is a free optical satellite data source utilized for monitoring land and sea surfaces. Although they mostly used for observing land surfaces, its applications have diversified in maritime sector as well. While open data condition and spectral resolution of Sentinel-2 is convenient for maritime observation, its spatial resolution is insufficient for obtaining higher detection accuracy particularly in the case of ships. In this thesis, the effects of super-resolution to the detectability of ships from Sentinel-2A optical satellite images was investigated and greenhouse gas emissions from shipping activities were estimated by connecting fuel consumption of ocean-going ships with ship instances. The thesis study consists of three main stages: training super-resolution model, training the object detection model, and estimation of shipping emissions. First two stages were designed for investigating the effect of super-resolution on ship detection performance. In these stages, optical satellite data was tailored to the structural needs of Real-ESRGAN and YOLOv10 deep learning models. Outputs such as enhanced images and detected ship instances from both original and enhanced images were generated. In the final stage, ship instances detected from enhanced images are retrieved from previous stages for further spatial analyses to estimate shipping emissions. To conduct super-resolution stage of the study, one of the novel branches of generative adversarial networks (GANs), Real-ESRGAN, was adopted before ship detection. To reduce the computational inefficiency and increase the robustness of object detection model on detecting ships, Dataset-1 and Dataset-2 consisting of PlanetScope and Sentinel-2A images were curated, respectively. While Dataset-1 was allocated for super-resolution, Dataset-2 was reserved for ship detection. Before training Real-ESRGAN, tiling and masking were applied to PlanetScopes images and LR-HR image pairs were produced by downsampling with bicubic interpolation method from 3 m to 12 m spatial resolution. Dataset-1 containing 37570 patch images was divided into 7:3 sampling scheme. The Real-ESRGAN model trained on Dataset-1 were evaluated by image quality metrics and obtained the values of 80.63, 29.67 dB and 0.84 for MSE, PSNR and SSIM, respectively. To conduct ship-detection stage of the study, sea-land segmentation was applied to Dataset-2 to reduce false detections. Dataset-2 containing 8320 masked images were enhanced four times with Real-ESRGAN model trained on Dataset-1. Among YOLOv10 models, YOLOv10m model was selected for gener,al usage purpose. YOLOv10m model was trained, validated and tested on both original and enhanced Dataset-2 on separate sessions with 7:2:1 sampling scheme. Annotations to ships on train and validation samples were implemented manually and a total of 13447 ships were labelled. All the ships were annotated with single ship label. Detection results of original and enhanced Dataset-2 were compared visually and statistically to observe the effect of super-resolution on the YOLOv10 model's ability to detect ships. Performance metrics of precision, recall, mAP50, and mAP50-95 were calculated to evaluate the YOLOv10 model's performance. mAP50 and mAP50-95 were found to experience 2.6% increase compared to original Sentinel-2A images. These findings show that the enhancement of Sentinel-2A images through super-resolution practices facilitates easier detectability of ship instances with fewer missed and false alarms by increasing texture and details in ships. Super-resolution enhances the accuracy of detection models by recovering the edge information of ship instances and increasing the number of correct detections. Recovered edges enable higher localization. Therefore, to conduct the final stage of the study, ship instances detected from enhanced Dataset-2 were analyzed for driving conclusion about the amount of shipping-related emission in port level. Corresponding ship instances were used as proxy data to infer shipping emissions in port of Antwerp in Belgium. Enhanced Dataset-2 test samples were utilized to estimate the emission levels of carbon dioxide (CO2), nitrous oxide (N2O) and methane (CH4). Since Dataset-2 contains Sentinel-2A images from various port locations, the analysis focused specifically on the images of Antwerp port because it provided the largest data size. A total of 565 detections was extracted from port of Antwerp. Available year range was between 2017 and 2023. Because irregular temporal distribution of acquisition dates prevents a reliable annual estimation, acquisition dates of images that represent a month was filtered and chosen to proceed with monthly emission estimations. Images of Antwerp were filtered down to 113 detections corresponding to 5 acquisition dates. Due to the regular acquisition distribution was encountered in March, emissions of March for 2022 was estimated. Since 85% of ships visiting the port of Antwerp corresponds to container ships and there is only one ship type considered, Tier 1 method was chosen as the emission estimation method provided by IPCC guideline 2006. By combining the coefficient of fuel consumed by ocean-going ships with filtered detections, average fuel consumption was estimated and multiplied by emission factor of each substance (CO2, N2O and CH4). As a result, levels of carbon dioxide, nitrous oxide and methane emissions were estimated as 26 448, 2.43 and 0.69 tonnes for March 2022.
