Özet

Son yıllarda derin öğrenme tabanlı yöntemler, görüntü sınıflandırma, nesne algılama ve endüstriyel kalite kontrol uygulamalarında yüksek başarı seviyelerine ulaşmıştır. Evrişimli sinir ağları, klasik görüntü işleme tekniklerine kıyasla daha güçlü özellik çıkarma kabiliyeti sunarak gıda endüstrisinde karşılaşılan kırık, yanık ve doku bozukluğu gibi kusurların hızlı ve güvenilir biçimde tespit edilmesini mümkün kılmaktadır. Bu çalışmanın amacı, bisküvi üretim sürecinde ortaya çıkan kusurların derin öğrenme tabanlı modellerle otomatik olarak sınıflandırılması ve tespit edilen kusurlu ürünlerin mekatronik bir ayrıştırma sistemi aracılığıyla üretim hattından uzaklaştırılmasıdır. Bu kapsamda, gerçek üretim hattını temsil eden bir konveyör düzeni üzerinde elde edilen toplam 4990 görüntü, kusursuz ve üç farklı kusur türü olacak şekilde etiketlenmiş ve çeşitli derin öğrenme mimarileri kullanılarak analiz edilmiştir. Çalışmada iki sınıflı (kusurlu, kusursuz) ve üç sınıflı (kırık, yanık, doku hatası) senaryolar altında çok sayıda evrişimsel sinir ağları tabanlı mimari ile YOLOv8 ailesinin performansı karşılaştırmalı olarak değerlendirilmiştir. Performans analizi doğruluk, F1 puanı ve toplam işlem süresi ölçütleri üzerinden gerçekleştirilmiştir. İki sınıflı problemde DenseNet201 modeli 0,962 doğruluk ile en yüksek başarıyı sağlamıştır. ResNet50 ve DenseNet169 modelleri 0,92–0,93 aralığında doğruluk ile kararlı performans sergilemiştir. İki sınıflı sınıflandırma probleminde, YOLOv8m, YOLOv8l ve YOLOv8x modelleri eşit biçimde en yüksek performansı sergileyerek 0,967 doğruluk değerine ulaşmıştır. Bu modelleri, 0,962 doğruluk ile DenseNet201 modeli yakından takip etmiştir. Buna karşılık, iki sınıflı problemde en düşük sınıflandırma başarısı, 0,868 doğruluk değeri ile NASNetMobile mimarisinde gözlemlenmiştir. Hesaplama verimliliği dikkate alındığında ise, MobileNet modeli 0,918 doğruluk değerine ek olarak yalnızca 838 saniyelik işlem süresi ile dikkat çekmiştir. Üç sınıflı sınıflandırma probleminde, YOLOv8m modeli 0,970 doğruluk ile tüm mimariler arasında en yüksek başarıyı elde etmiştir. ResNet101 modeli 0,950 doğruluk değeri ile güçlü bir performans sergilerken, DenseNet201 modeli hem 0,948 doğruluk hem de 0,948 F1 puanı ile istikrarlı ve dengeli bir sınıflandırma yeteneği ortaya koymuştur. Üç sınıflı problemde en düşük doğruluk değeri, 0,923 ile Xception modelinde gözlemlenmiştir. Diğer yandan, hesaplama maliyeti açısından değerlendirildiğinde, VGG16 modeli 1170,924 saniyelik işlem süresi ile öne çıkmış ve yüksek hesaplama gereksinimine sahip mimariler arasında en belirgin örneklerden biri olmuştur. Modeller, geliştirilen mekatronik ayrıştırma sistemi ile gerçek zamanlı olarak entegre edilmiştir. Raspberry Pi üzerinde çalışan sınıflandırma çıktıları Arduino Mega üzerinden delta robotu yönlendirerek kapalı çevrim bir ayrıştırma süreci oluşturmuştur. Elde edilen deneysel sonuçlar hem evrişimsel sinir ağları tabanlı mimarilerin hem de YOLOv8 ailesinin bisküvi üretim hatları gibi hızlı ve hassas ayrıştırma gerektiren endüstriyel uygulamalarda yüksek doğrulukla ve gerçek zamanlı olarak kullanılabilir olduğunu ortaya koymaktadır.

In recent years, deep learning–based methods have achieved high levels of success in image classification, object detection, and industrial quality control applications. Convolutional neural networks provide substantially stronger feature extraction capabilities than conventional image processing techniques, enabling the rapid and reliable detection of defects such as not complete, overcooked, and texture defect commonly encountered in the food industry. The objective of this study is to automatically classify defects occurring during the biscuit production process using deep learning based models and to remove defective products from the production line via a mechatronic sorting system. Within this framework, a total of 4,990 images were collected from a conveyor-based experimental setup representing a real production line. The images were annotated as no defect or belonging to one of three defect categories and subsequently analyzed using various deep learning architectures. The performance of multiple CNN-based models and the YOLOv8 family was comparatively evaluated under two-class defect, no defect and three class not complete, overcooked, texture defect problems. Performance assessment was conducted based on accuracy, F1-score, and total processing time. For the two classes defect, no defect problem, the DenseNet201 model achieved the highest performance with an accuracy of 0.962. The ResNet50 and DenseNet169 models demonstrated stable performance, achieving accuracy values in the range of 0.92–0.93. Among the binary classification models, YOLOv8m, YOLOv8l, and YOLOv8x exhibited the highest performance equally, reaching an accuracy of 0.967, closely followed by DenseNet201 with an accuracy of 0.962. Conversely, the lowest classification performance in the binary scenario was observed for the NASNetMobile architecture, with an accuracy of 0.868. Considering computational efficiency, the MobileNet model stood out by achieving an accuracy of 0.918 while requiring only 838 seconds of processing time. In the multiclass classification task, the YOLOv8m model achieved the highest accuracy among all architectures with a value of 0.970. The ResNet101 model demonstrated strong performance with an accuracy of 0.950, while the DenseNet201 model exhibited a stable and balanced classification capability, achieving both an accuracy and an F1-score of 0.948. The lowest accuracy in the multiclass scenario was observed for the Xception model, with a value of 0.923. From a computational cost perspective, the VGG16 model stood out with a processing time of 1,170.924 seconds, representing one of the most computationally demanding architectures evaluated in this study. The trained models were integrated in real time with the developed mechatronic sorting system. Classification outputs running on a Raspberry Pi were transmitted via an Arduino Mega to control a delta robot, forming a closed-loop sorting process. The experimental results demonstrate that both CNN-based architectures and the YOLOv8 family can be effectively employed with high accuracy and in real time for industrial applications requiring fast and precise sorting, such as biscuit production lines.
