Özet

Günümüzde artan insan popülasyonu ve teknolojinin devamlı gelişimiyle birlikte enerji kaynaklarına duyulan ihtiyaç artmıştır. Konvansiyonel enerji kaynaklarının sınırlı ve de doğaya zararlı olması sebebiyle, uluslar yenilenebilir enerji kaynaklarını tercih etmeye başlamıştır. Yenilenebilir enerji sektörüne olan talep artmıştır ve bu doğrultuda üretilecek olan enerjinin tahmin edilebilmesi önem kazanmıştır. Bu tez çalışmasında, bu tahminlerin doğruluğunun iyileştirilmesi hedeflenmiştir. Bu doğruluk enerji piyasalarında ekonomik olarak büyük önem taşımaktadır. Bu kapsam doğrultusunda, bu tez çalışmasında Türkiye'nin Manisa ili Akhisar bölgesinde yer alan Akhisar Rüzgar Enerji Santrali (RES) için Hava Tahmin ve Araştırma Modeli (WRF- Weather Research and Forecasting) modeli kullanılarak yüksek çözünürlüklü rüzgar tahminleri elde edilmiştir. Çalışma 2021 yılına ait Ocak, Nisan, Temmuz ve Ekim aylarını içerir ve bu aylar mevsimleri temsilen seçilmiştir. Modelden elde edilen rüzgar şiddeti, rüzgar yönü, hava sıcaklığı ve yüzey basıncı gibi meteorolojik parametreler ile türbin seviyesindeki (80m) güç üretimi değerleri, aynı periyottaki gerçek türbin noktalarındaki üretim verileriyle karşılaştırılmıştır. Bu tez çalışmasında ilk adım olarak WRF modelinin ürettiği güç tahminleri ile gerçek üretim verileri karşılaştırılmıştır ve zaman serisi olarak sunulmuştur. Bu karşılaştırmalarda WRF modelinin trendi yakalamaya çalıştığı fakat genel olarak gerçek üretime göre daha fazla tahmin ettiği görülmüştür. Bu farkları detaylı açıklayabilmek için her ay içerisinden modelin tahminde en kötü olduğu birer gün belirlenmiş ve sinoptik analizi yapılmıştır. Bu analizlere göre gerçek üretim değerleri ile modelin tahmin ettiği üretim değerleri arasındaki farkın fazla olması, o gün için kararsızlığa sebep olan atmosferik koşulların bulunmasıyla ilişkilendirilmiştir. Tezin ikinci adımında ise, WRF modelinden elde edilen çok sayıda meteorolojik parametre girdi olarak Random Forest (RF), K-Nearest Neighbors (KNN), Extreme Gradient Boosting (XGBoost), Destek Vektör Regresyonu (SVR-Support Vector Regression) ve Çok Katmanlı Algılayıcı (MLP- Multilayer Perceptron) algoritmalarına sunulmuştur ve WRF modeliyle çıkartılan üretim değerleri iyileştirilmeye çalışılmıştır. Bunun için her ayın ilk 20 günü eğitim, son 10 günü test için ayrılmıştır. Test dönemine ait makine öğrenmesi yöntemleri karşılaştırılmıştır. Performans değerlendirmesi Ortalama Mutlak Hata (MAE-Mean Absolute Error), Kök Ortalama Kare Hatası (RMSE-Root Mean Square Error), Normalize Edilmiş Ortalama Mutlak Hata (NMAE- Normalized Mean Absolute Error), Normalize Edilmiş Ortalama Kök Kare Hata (NRMSE-Normalized Root Mean Square Error) ve Pearson korelasyon katsayısı (r) hata metrikleriyle yapılmıştır. Makine öğrenmesi sonuçları, tüm aylarda yüksek performans göstermiştir. Ocak, Nisan, Temmuz ve Ekim aylarına ait hata metrikleri incelendiğinde RF ve XGBoost modellerinin en başarılı iki yöntem olduğu görülmüştür. RF modeli için aylara göre MAE değerleri 37–72 kW aralığında, NMAE değerleri ise yüzde 1.6–2.9 seviyelerinde hesaplanmıştır; XGBoost yönteminde ise benzer şekilde düşük hata oranları ve yüksek korelasyon katsayıları görülmüştür (r ≈ 0.984–0.991). Bu iki modelin performansı özellikle Nisan ve Ekim aylarında gerçek üretim serisiyle yüksek doğruluk sağlamıştır. MLP ve KNN modelleri orta düzeyde başarı gösterirken, SVR modelinin tüm aylarda en yüksek hataları üreten yöntem olduğu anlaşılmıştır. Sunulan test dönemi zaman serilerinde RF ve XGBoost modelleri gerçek güç eğrisini en iyi yakalayan iki yöntem olmuştur. Bu modeller üretimdeki artım ve azalımları iyi takip ederken; SVR ve KNN özellikle sıfıra yakın üretim periyotlarını takip etmekte zorlanmıştır. MLP ise bazı günlerde pik değerleri kaçırsa da genel eğilimi uyumlu şekilde takip etmiştir. Genel olarak, orta ölçekli bir hava tahmin modeli olan WRF modelinin, saha ölçeğinde türbin bazlı üretim değişkenliğini tahmin etmekte zorlandığı düşünülmektedir. Bu kapsamda, makine öğrenmesi yöntemlerinin, WRF tahmin modelinin istatistiksel olarak iyileştirilmesini sağlayan bir art-işleme (post-processing) yaklaşımı olarak başarılı olduğu anlaşılmıştır. WRF modelden elde edilen meteorolojik parametrelerin modele dahil edilmesi etkisiyle, özellikle Random Forest ve XGBoost algoritmaları, hata değerlerini düşürmüş ve gözlemlerle olan korelasyonu arttırmıştır. Bu sonuçlar, orta ölçekli sayısal tahmin modellerinin veri ve istatistik odaklı makine öğrenmesi yöntemleriyle kuple edilmesinin, kısa dönem rüzgar enerjisi tahminlerinde daha doğru ve operasyonel olarak uygulanabilir olduğunu göstermektedir. Bu çalışma, fiziksel modellerin veri odaklı yöntemlerle birlikte kullanıldığında daha güvenilir ve operasyonel olarak uygulanabilir tahminler sağlayabileceğini göstermektedir. Gelecekte, modelin farklı sahalarda, farklı rüzgar türbini tipleriyle ve daha uzun periyotlu verilerle test edilmesi, yöntemin doğruluğunun açıklanmasında yardımcı olacaktır.

Energy resources are very critical for modern life because they are necessary for our homes, industries, transportation and communication systems etc. Almost every activity in daily life, from basic household needs to large-scale industrial production, depends directly on the availability of reliable energy. Due to the fact that with the increasing human population and continuous technological and economical advancements, the need and demand for energy resources has grown. As a result, energy consumption has reached unprecedented levels in many parts of the world. Many countries face with lack of energy sources. This situation increases energy dependency, economic vulnerability, and concerns about energy security. Due to the limited and environmentally harmful nature of conventional energy sources, nations have begun to prefer renewable energy sources. Fossil fuels not only have finite reserves but also cause serious environmental problems such as greenhouse gas emissions and air pollution. Using renewable sources like wind, solar, hydrothermal, geothermal etc. is very essential for combating climate change and decreasing the environmental impacts of conventional energy. In addition, renewable energy sources offer a cleaner, more sustainable, and locally available alternative for meeting future energy needs. Demand for the renewable energy sector has increased, making the prediction of energy production became crucial because these sources are highly dependent on weather conditions which can vary over time significantly. This variability creates challenges for power system planning, grid stability, and energy market operations. This thesis aims to improve the accuracy of these predictions, which is of great economic importance in energy markets. More accurate forecasts can help reduce operational costs, support decision-making processes, and enhance the integration of renewable energy into existing power systems. In this context, high-resolution wind forecasts were obtained for the Akhisar Wind Energy Plant (WEPP) located in the Akhisar region of Manisa province, Turkey, using the Weather Research and Forecasting (WRF) model. The study covers the months of January, April, July, and October of 2021, selected to represent the seasons. Meteorological parameters such as wind speed, wind direction, air temperature, and surface pressure obtained from the model, along with power generation values at the turbine level (80m), were compared with actual production data from turbine locations during the same period. In this thesis, the first step involved comparing the power predictions generated by the WRF model with actual production data, and these comparisons were presented as time series. These comparisons showed that the WRF model attempted to capture the trend but generally predicted more than the actual production. To explain these differences in detail, one day with the worst prediction for the model was selected each month, and a synoptic analysis was performed. According to these analyses, the large difference between the actual production values and the production values predicted by the model was attributed to the presence of atmospheric conditions causing instability on that day. In the second step of the thesis, a lot of meteorological parameters obtained from the WRF model were fed as input to Random Forest (RF), K-Nearest Neighbors (KNN), Extreme Gradient Boosting (XGBoost), Support Vector Regression (SVR), and Multilayer Perceptron (MLP) algorithms, and attempts were made to improve the production values extracted by the WRF model. For this purpose, the first 20 days of each month were allocated for training, and the last 10 days for testing. Machine learning methods from the test period were compared. Performance evaluation was conducted using Mean Absolute Error (MAE), Root Mean Square Error (RMSE), Normalized Mean Absolute Error (NMAE), Normalized Root Mean Square Error (NRMSE), and Pearson correlation coefficient (r) error metrics. The machine learning results showed high performance in all months. Examining the error metrics for January, April, July, and October, the RF and XGBoost models were found to be the two most successful methods. For the RF model, MAE values ranged from 37–72 kW per month, while NMAE values were calculated at 1.6–2.9%; similarly, the XGBoost method showed low error rates and high correlation coefficients (r ≈ 0.984–0.991). The performance of these two models, particularly in April and October, demonstrated high accuracy with the actual production series. While the MLP and KNN models showed moderate success, the SVR model was found to be the method producing the highest errors in all months. In the presented test period time series, the RF and XGBoost models were the two methods that best captured the real power time serie. While these models accurately tracked increases and decreases in production, SVR and KNN struggled to track periods of near-zero production. Although MLP missed peak values on some days, it consistently followed the overall trend. Overall, it is considered that the WRF model, a medium-scale weather forecasting model, struggles to predict turbine-based production variability at the field scale. This limitation caused by the complex and highly local nature of wind behavior around wind farms, which cannot always be fully captured by medium-scale numerical models. In this context, machine learning methods have proven successful as a post-processing approach that statistically improves the WRF forecasting model. These methods are able to learn hidden patterns and nonlinear relationships between meteorological variables and power production. The inclusion of meteorological parameters obtained from the WRF model, especially in the Random Forest and XGBoost algorithms, reduced error values and increased correlation with observations. This improvement indicates that machine learning algorithms can effectively extract useful information from numerical weather prediction outputs. These results demonstrate that combining medium-scale numerical prediction models with data and statistics-driven machine learning methods is more accurate and operationally feasible for short-term wind energy forecasting. Such hybrid approaches help overcome the individual limitations of both physical and purely data-driven models. This study shows that physical models, when used in conjunction with data-driven methods, can provide more reliable and operationally viable predictions. The findings highlight the importance of integrating numerical weather prediction models with advanced machine learning techniques for practical applications in the energy sector. In the future, testing the model in different locations, with different types of wind turbines, and with longer data periods will help clarify the accuracy of the method. These future studies will also contribute to understanding the generalizability and robustness of the proposed approach under varying climatic and operational conditions.
