Aim: The determination of whether a signature or paraph belongs to a particular individual is a critical issue in forensic document examination that directly affects the judicial outcome of many legal disputes, particularly graphological denial cases. In current practice, the forensic document examiner's evaluation based on visual comparison is both time-consuming and dependent on the examiner's experience. This study aims to develop a deep learning-based decision-support model capable of accelerating and standardizing expert opinion. Within this scope, a multi-modal verification framework was designed that addresses not only the genuine-versus-forged distinction of signatures, but also the identification of which forger produced a forged sample, and that incorporates paraphs alongside signatures into the evaluation. The performance of different deep learning architectures across these three tasks was comparatively examined, and the models' performance was also compared with the assessments of forensic document examiners on the same test samples. Materials and Methods: Genuine signature, paraph, and five additional character (W, Ş, İ, O, α) samples were collected in two separate sessions from 21 volunteers aged 18-65 with no known neuromuscular disorders. For three target participants selected from the same 21 volunteers, forged samples were produced by the remaining 18 participants and by the target participants imitating each other through imitation by visual reference (with the target sample visible during writing); a dataset of 9,750 images was thus formed, comprising 7,350 genuine and 2,400 forged samples. For classification, convolutional neural network models with VGG-16, ResNet-50, MobileNetV3-Large, and EfficientNetV2-S backbones, together with a Siamese network using an EfficientNetV2-S backbone, were evaluated within a three-stage design (Stage 0: writer-identity classification; Stage 1: genuine-versus-forged signature verification; Stage 2: closed-set forger identification). The Stage 1 and Stage 2 performance of the models was additionally compared with the decisions of five court-registered forensic document examiners on the same test samples. Results: In Stage 0, VGG-16 and EfficientNetV2-S achieved the highest writer identification accuracy with Top-1 = 0.9303. In Stage 1, the Siamese network achieved a zero false acceptance rate (FAR = 0.0000) across all subgroups, while EfficientNetV2-S stood out with the lowest equal error rate (EER = 0.0219); two models (ResNet-50 and EfficientNetV2-S) achieved errorless classification in the signature subgroup. In Stage 2, EfficientNetV2-S was the most successful model with Top-1 = 0.8583 and Top-5 = 0.9722. Forensic document examiners achieved high accuracy (93.3%) in the genuine-versus-forged distinction, performing comparably to the models in this task. However, in forger identification, expert performance declined notably and fell behind the deep learning models. Conclusion: The findings indicate that deep learning-based models can achieve high performance for signature-paraph verification on a controlled dataset and may carry potential as an auxiliary decision-support approach to assist expert evaluation in the forensic document examination process. Nonetheless, transition to routine forensic practice requires larger-scale, multi-center, and real-case external validation studies.
